Capsaicin isn't very soluble in water, as I recall, somewhat bitterly.
Honestly a box of XL latex gloves in the kitchen was one of the best investments I ever made in there. I mean I love my sous vide and my air fryer but those gloves have spared me from a looooot of pain.
Improving your ventilation also helps a lot, but may be difficult or bot worth it if you rent.

I've been doing that every since I used my bare hands and then burned my eyes putting in contacts for the next three days. Not sure what solvent/cleaner will remove capsacin from your skin but apparently not soap!
